Check all token IDs in the tokenizer identity check.
validate_tokenizer_against_base skips every base token with an ID of 256 or greater. Equal-sized tokenizers can therefore agree on IDs 0–255, disagree on later IDs, and pass this check. forward compares teacher and draft logits by output-column index, so those differences can train against different token meanings.
The docstring promises agreement on what the IDs mean. No narrower prefix-only contract is documented.

Validate external_loss when the configuration is created.
ExternalDraftConfig.external_loss accepts arbitrary strings because it is declared as str. HFExternalDraftModel.modify later rejects unsupported values during conversion. Therefore, the current code does not defer the failure to the forward pass on the normal conversion path.
Use a Literal to reject invalid values at configuration creation. The existing plugin check and invalid-objective test should remain as defense in depth.

| # EagleTrainerWithAccLog logs outputs.train_acc; anything else is dropped. | ||
| draft_out.train_acc = [acc.detach()] |
There was a problem hiding this comment.
[IMPORTANT Compatibility] train_acc is one nesting level shallower than the consumer named in the comment expects, which makes the logging callback raise.
The comment cites EagleTrainerWithAccLog. Tracing that consumer in examples/speculative_decoding/eagle_utils.py:
# compute_loss (line 285)
if hasattr(outputs, "train_acc") and any(outputs.train_acc):
self.state.training_accs.append(outputs.train_acc)
# on_log (lines 439, 448-450)
average_acc = np.mean(state.training_accs, axis=0)
for i, draft_acc in enumerate(average_acc):
for j, step_acc in enumerate(draft_acc):
logs[f"train_acc/parallel_{i}_step_{j}"] = float(step_acc)The callback requires a 2-D [parallel][step] structure. Every sibling plugin supplies it: hf_dflash.py:1007, hf_dspark.py:417, and hf_domino.py:383 all emit train_acc=[[accuracy]], and hf_eagle.py:828 emits train_accs[:, :num_ttt_steps].tolist() (a list of lists). This line emits a flat [acc].
Failure scenario: external_report_acc defaults to True, so with a single-element flat list each appended entry has shape (1,); np.mean(..., axis=0) returns a 1-D array of length 1; draft_acc is then a scalar np.float64, and enumerate(draft_acc) raises TypeError: 'numpy.float64' object is not iterable. The print_rank_0 call just above is wrapped in try/except Exception, but this loop is not — so the run dies at the first logging step under the default config. (Not reachable in-tree yet since the example wiring lands in a later PR of the series, which is why CI is green.)
Fix — match the sibling convention:
| draft_out.train_acc = [acc.detach()] | |
| draft_out.train_acc = [[acc.detach()]] |
| ), | ||
| ) | ||
|
|
||
| external_loss: str = ModeloptField( |
There was a problem hiding this comment.
[SUGGESTION] external_loss is typed as bare str, so the allowed-value check lives only in the HF plugin and runs late.
hf_external.py:50-54 validates the three legal values inside HFExternalDraftModel.modify(). That means ExternalDraftConfig(external_loss="tdv") (transposed typo) constructs cleanly, and the error surfaces only at mtsp.convert() time — and only for HF models, since any future non-HF ExternalDraftModel subclass that doesn't repeat the check would accept the bad value and silently fall through compute_loss's else branch to soft_ce (the if self.external_loss in ("tvd", "tvd_deploy") test at hf_external.py:216 treats everything else as soft-CE).
CONTRIBUTING's coding standards put this at the config: "Validate external input once. Check types and values at the interface boundary. Internal code can trust those checks and avoid redundant assertions." A Literal gives the check for free, at construction, for every subclass, and Pydantic's error names the valid options:
external_loss: Literal["soft_ce", "tvd", "tvd_deploy"] = ModeloptField(
default="tvd",
description=(...),
)With that in place the modify() raise at hf_external.py:50-54 becomes redundant and can be removed.
| if loss_mask is None: | ||
| loss_mask = torch.ones( | ||
| input_ids.shape, dtype=draft_out.logits.dtype, device=draft_out.logits.device | ||
| ) |
There was a problem hiding this comment.
[CRITICAL Algorithm] The loss_mask fallback ignores attention_mask, so padding tokens are trained on at full weight.
attention_mask is accepted as a parameter on this forward (line 85) and forwarded to the draft at line 108, but the fallback here builds an unconditional all-ones mask over input_ids.shape. Every sibling plugin derives the fallback from the attention mask instead — hf_eagle.py:702-706:
if loss_mask is None:
# By default, mask out padding tokens in loss computation
loss_mask = (
attention_mask.clone().detach()
if attention_mask is not None
else torch.ones_like(input_ids, dtype=torch.bool)
)Failure scenario: a right-padded batch (attention_mask = [1,1,1,0,0], the normal HF collator output) with no explicit loss_mask. The pad positions contribute two ways:
compute_losssums over all positions and divides bymask.sum()(lines 214, 224) — pad columns enter both numerator and denominator, so the reported loss is diluted toward whatever the draft/base agree on at pad positions rather than being the real objective.- Gradient flows from those positions, actively training the draft to match the base on pad tokens — tokens it will never be asked to draft at serving time.
The effect scales with padding fraction: on a batch of mixed-length sequences padded to the longest, a large share of the gradient signal can come from positions that should be masked out. Accuracy reporting (lines 230-235) is skewed the same way, since valid = mask.bool() is all-true.
This is reachable on the default config — loss_mask is optional in the signature, and only the offline collator guarantees it. The in-tree tests always pass an explicit loss_mask (test_external_draft_offline.py:_offline_batch), so nothing catches it.
Fix — mirror the sibling convention:
if loss_mask is None:
# By default, mask out padding tokens in loss computation
loss_mask = (
attention_mask.clone().detach()
if attention_mask is not None
else torch.ones_like(input_ids)
)
loss_mask = loss_mask.to(draft_out.logits.dtype)A test covering the padded-batch-without-loss_mask case would be worth adding alongside it.

There was a problem hiding this comment.
[SUGGESTION] The external_loss placeholder default here ("soft_ce") contradicts ExternalDraftConfig's default ("tvd", config.py:487).
modify() (line 40) always overwrites every one of these from the config, so no code path observes the discrepancy today — the other four placeholders (external_offline, external_report_acc, external_top_k, external_top_p) all match their config counterparts, which is what makes this one read as an oversight rather than a deliberate choice.
It matters for two reasons: anyone inspecting a converted model mid-debug sees "soft_ce" as the "base" default and may conclude that is what an unconfigured draft trains with, and the two numbers drift independently the next time the config default is revisited. Single source of truth, per CONTRIBUTING.

Claude review — [2/8] Add the external draft speculative-decoding mode
Scope. Trigger was a bare /claude review, so this is a full review. 11 changed files (+865/−2); I reviewed all 6 modelopt/ source files and both new test files. No examples/ files are touched by this slice. Per the PR description I treated only the final commit (1983863f) as in scope and diffed against origin/ext-draft/1-dump-path.
Findings — CRITICAL: 2, IMPORTANT: 3, SUGGESTION: 2
Most impactful
1. forward returns a loss that HF Trainer cannot see (hf_external.py:117) — the headline issue. Line 108 calls super().forward() without labels, so the returned CausalLMOutputWithPast has loss=None and therefore no loss dict key. ModelOutput.__setattr__ only writes through to the mapping when the name is already a key, so draft_out.loss = loss sets an attribute only. Trainer.compute_loss reads outputs["loss"] (with an explicit comment that it avoids .loss because models may return tuples) and raises ValueError: The model did not return a loss from the inputs, only the following keys: logits. Training never starts under any Trainer-driven run. The in-tree tests read .loss as an attribute, which works, so nothing catches it. Every sibling plugin instead builds a fresh ModelOutput(loss=..., train_acc=...); doing the same here fixes this plus findings 2 and 3 in one edit.
2. loss_mask fallback ignores attention_mask (hf_external.py:112-115) — builds an unconditional all-ones mask, so on a right-padded batch with no explicit loss_mask the pad positions enter both the loss numerator and the mask.sum() denominator and contribute gradient, training the draft to match the base on tokens it will never draft. hf_eagle.py:702-706 derives the fallback from attention_mask for exactly this reason. Accuracy reporting is skewed the same way.
3. train_acc is one nesting level too shallow (hf_external.py:120) — emits [acc] where the consumer named in the comment, EagleTrainerWithAccLog, requires [parallel][step]. eagle_utils.py:448-450 does a nested enumerate, which raises TypeError: 'numpy.float64' object is not iterable at the first logging step under the default external_report_acc=True. All four sibling plugins emit [[accuracy]].
Rounding out the IMPORTANT tier: ExternalDraftConfig is missing from config.py's __all__, so mtsp.ExternalDraftConfig raises AttributeError while every sibling config resolves; and external_offline is written but never read anywhere in the tree, so external_offline=False is accepted and silently ignored rather than rejected at the boundary.
What holds up well
The design intent is sound and the documentation of it is unusually good. The tvd_deploy objective is correct — under rejection sampling the acceptance probability is sum(min(p, q)), so 1 − TVD really is the deployment metric rather than a proxy, and applying the filter to both sides is the right way to measure it. The renormalisation between top-k and top-p in _deployment_probs is correct and the comment explaining why skipping it would make top-p a no-op is exactly the kind of non-obvious constraint worth a comment. The soft_ce branch matches hf_eagle._eagle_loss in form, fp32 upcasts are in place before every softmax, and the clamp_min guards are present. Holding the base head off the module tree via object.__setattr__ with the compensating explicit .to(device) is a reasonable trade, and the GPU test exists precisely because no CPU test can observe it. validate_tokenizer_against_base checking vocabulary identity rather than just size is the right call. Conversion/restore mirrors the EAGLE pattern, carries empty metadata, and round-trips cleanly; the plugin is correctly gated behind import_plugin("transformers"). The save_pretrained override restoring config.architectures to the original class name is a real downstream-loading fix and the rank guard against the FSDP read-modify-write race is the right detail to have caught.
Risk
Medium-high for the training path, low for everything else. Findings 1-3 all sit on the default-config training path and each one breaks a Trainer-driven run at or before the first logging step — but they are confined to HFExternalDraftModel.forward and the fix is a single block replacement following the established sibling convention. The mode registration, config schema, conversion/restore, and export surfaces are correct as written. Nothing here affects existing checkpoints or other modes: the mode is new, modelopt_state is unchanged, metadata is empty, and the only edit to shared files is one import line each. Because the example wiring that exercises forward lands in a later PR of the series, CI on this slice is green and will stay green — these will surface when [3/8] or later connects the trainer, which is an argument for fixing them here rather than there.
One verification caveat, stated plainly: I was unable to execute a Python probe in this environment to confirm finding 1 empirically (sandbox blocked it). That finding is reasoned from ModelOutput.__post_init__ / __setattr__ and Trainer.compute_loss semantics rather than observed — worth a 30-second local check of "loss" in draft(**batch) before acting on it, though I'd expect it to confirm.
CodeRabbit's open finding about validate_tokenizer_against_base only checking ids below sample is a fair point I did not duplicate.

Findings — CRITICAL: 1, IMPORTANT: 0, SUGGESTION: 0
Since the last round
Four of the five blocking findings from the previous review are fixed, and I re-verified each against the current code rather than taking the diff on trust:
loss_maskfallback now derives fromattention_mask(hf_external.py:131-138), matchinghf_eagle.py:701-707, so pad positions no longer enter the numerator, the denominator, or the gradient._train_accnow double-nests to[[acc]]with a docstring explaining the[parallel_draft][ttt_step]contract thateagle_utils.py:448-450iterates — matching all four siblings.ExternalDraftConfigis now exported fromconfig.py's__all__(line 33), somtsp.ExternalDraftConfigresolves like every sibling config.external_offline=Falseis now rejected inmodify()with a comment explaining why the check belongs there and not in the schema — the flag is part ofmodelopt_state, so tightening the schema would make an already-saved checkpoint unrestorable.test_online_mode_is_rejected_at_convert_not_in_the_schemapins both halves of that reasoning. Nice.
CodeRabbit's two config items also landed: external_loss is now a Literal, and external_top_k/external_top_p carry ge/le bounds while preserving 0 as the no-filter sentinel.
The one that remains
draft_out.loss = loss is invisible to HF Trainer (hf_external.py:140) — this is the finding I flagged last round as reasoned-but-unverified, and it is the only one not addressed. super().forward() is called without labels, so the output is constructed with loss=None; ModelOutput.__post_init__ omits None fields from the dict view and __setattr__ writes through only for keys already present, so the later assignment sets an attribute while the loss key stays absent from the mapping. Trainer.compute_loss reads the loss by subscript — deliberately not via the attribute, because models may return tuples — and raises ValueError: The model did not return a loss from the inputs, only the following keys: logits. The same applies to train_acc, which is not a field of CausalLMOutputWithPast at all. The fix is the sibling convention: construct a fresh ModelOutput passing loss, logits and train_acc to the constructor. Details and a patch are in the inline comment.
A note on verification, since I raised this once before on reasoning alone: transformers is not importable in this environment and pip/find probes were sandbox-blocked, so I again could not confirm it empirically. What I could verify in-repo strengthens it — hf_external.py:140 is the only place in modelopt/torch/speculative/ or modelopt/torch/distill/ that mutates .loss post-construction; every other plugin passes it to the constructor. A 30-second local check that the loss arrives as a dict key (subscript, not attribute) settles it either way, and that assertion is worth keeping as a regression test regardless, because the current tests read .loss as an attribute and so cannot observe the difference.
What holds up well
The tvd_deploy objective is correct: under rejection sampling the acceptance probability is sum(min(p, q)), so 1 - TVD is the deployment metric itself rather than a proxy, and filtering both sides is the right way to measure it. The renormalisation between the top-k and top-p stages in _deployment_probs is correct, and the comment explaining that skipping it would make top-p a no-op whenever the top-k mass already sits below the threshold is exactly the kind of non-obvious constraint worth writing down. The soft_ce branch matches hf_eagle._eagle_loss in form, fp32 upcasts precede every softmax, and the clamp_min and +1e-5 guards are in place. Logit/mask alignment is right for this mode specifically — the draft and the base both predict token t+1 at position t, so the +1 shift EAGLE needs would be wrong here, and its absence is correct rather than an oversight.
Holding the base head off the module tree via object.__setattr__ is a sound trade: it keeps base weights out of the draft's state_dict (pinned by test_base_lm_head_absent_from_draft_state_dict) at the cost of .to(device) not reaching it, which the explicit device check compensates for and the GPU test covers because no CPU test can. Routing teacher logits through the shared _maybe_apply_base_final_norm so a pre-norm capture with no norm available fails loudly beats training against an un-normed residual behind a plausible loss curve. validate_tokenizer_against_base checking vocabulary identity rather than width is the right call. Conversion/restore mirrors the EAGLE pattern with empty metadata and round-trips cleanly; the plugin is correctly gated behind import_plugin for transformers. The save_pretrained override restoring config.architectures to the original class name is a real downstream-loading fix, and the is_main_process guard against the FSDP read-modify-write race is a good catch.
Risk
Low-to-medium, and narrowly scoped. The remaining issue sits on the default training path and blocks any Trainer-driven run, but it is four lines inside forward and the fix follows an established in-tree convention. Everything structural is correct as written: mode registration, config schema, conversion/restore, and the export surface. Nothing affects existing checkpoints or other modes — the mode is new, modelopt_state is unchanged, metadata is empty, and the only edits to shared files are one import line each. Because the example wiring that exercises forward lands later in the series, CI here is green and will stay green, so this will surface in a later slice unless fixed now.
CodeRabbit's open finding about validate_tokenizer_against_base only checking ids below sample is a fair point I have not duplicated.

- Skip building the aux planes under --no-aux-hidden-states: the concatenation and device-to-host copy ran per conversation on a dump about to drop them. - Document aux_hidden_states_optional beside its sibling arguments, and record in the dump-format key list that the key is absent under --no-aux-hidden-states. That list is the contract a new producer or consumer is written against. - Let sample_hidden_states inspect dumps that omit an optional key. It compared the whole key set, so it reported every --no-aux-hidden-states dump as damaged, and every --answer-only-loss dump along with it. Unlike Eagle/Medusa/DFlash, the converted module *is* the draft: an ordinary pretrained causal LM that owns its embeddings and lm_head. The base model is never grafted onto it and is not modified; it contributes only cached hidden states, which the base lm_head projects to teacher logits. The trained draft therefore exports as a plain HF checkpoint that downstream runtimes load with no mode-specific support. external_loss selects the objective: soft_ce reproduces the Eagle offline loss, tvd is total-variation distance, and tvd_deploy puts both sides through the serving filter first so the loss is the acceptance the deployed pair sees. Part of a five-PR series; this slice is the library mode only. The recipe and training entrypoint follow in [3/5]. @kevalmorabia97 can I get a review for this one next? What should be the process for the remaining prs? although ti does seem someone else has approved this one :) |
### What does this PR do? > **Supersedes #2636.** That PR was merged into `ext-draft/1-dump-path` rather than `main` -- its base never retargeted after [1/8] landed -- so its contents never reached upstream. This branch carries the identical change, now rebased to a single commit directly on `main`. Part of an eight-PR series; merge order [2/8] -> [3/8] -> [4/8] -> [5/8] -> [6/8] -> [7/8] -> [8/8]. Type of change: new feature Unlike Eagle/Medusa/DFlash, the converted module *is* the draft: an ordinary pretrained causal LM that owns its embeddings and lm_head. The base model is never grafted onto and is not modified; it contributes only cached hidden states, which the base lm_head projects to teacher logits. The trained draft therefore exports as a plain HF checkpoint that downstream runtimes load with no mode-specific support. `external_loss` selects the objective: | value | scores | |---|---| | `soft_ce` | cross-entropy against the base's soft distribution (the EAGLE offline objective) | | `tvd` | total-variation distance between the two full distributions | | `tvd_deploy` | the same, both sides through the serving filter first | Under rejection sampling the acceptance probability is exactly `sum(min(p, q))`, so `tvd_deploy` is `1 - acceptance` — the deployment metric itself rather than a proxy. Teacher logits go through the shared `_maybe_apply_base_final_norm`, so a producer that captured a pre-final-norm hidden with no norm available fails loudly instead of training against an un-normed residual. `validate_tokenizer_against_base` checks vocabulary *identity*, not just size: different tokenizers are routinely padded to the same width, and a mismatch otherwise yields a falling loss curve and no acceptance. ### Usage ```python import modelopt.torch.speculative as mtsp draft = AutoModelForCausalLM.from_pretrained("<draft>") mtsp.convert(draft, [("external", {"external_loss": "tvd", "external_top_k": 20})]) draft.attach_base_lm_head(base.get_output_embeddings(), base_final_norm) ``` ### Testing `pytest tests/unit/torch/speculative` and `tests/gpu/torch/speculative/plugins/test_hf_external.py`. **End-to-end validation.** The series was exercised by running the whole workflow on real models, not unit tests alone: a teacher policy was dumped from a 27B target, three drafts were trained against it concurrently from one dump -- two sharing the target's tokenizer, one needing the cross-tokenizer vocabulary swap -- each for a full epoch, and each exported a plain HF checkpoint whose `architectures` resolves to the draft's own class. Acceptance was then measured for all three under a matched target policy. That run surfaced four defects this series' unit tests and several review passes had all missed, two of which corrupted training silently rather than failing; all four are fixed here. **Loss-path peak memory.** `_deployment_probs` takes the nucleus over the `top_k` kept values rather than sorting the whole vocabulary, which removes a full-vocab sort, its int64 index tensor, the cumsum and the mask. Measured by @kevalmorabia97 on one RTX 6000 Ada, forward plus backward on a `[1, 2048, 152000]` bf16 logits tensor, peak over baseline: | `top_k` | before | after | |---|---|---| | 20 (the default) | 14.0 GB | **6.2 GB** | | 0 (no top-k, full-sort path) | 11.2 GB | 11.2 GB | One consequence: ties on the k-th probability now keep exactly `k`, matching the dumper, where `p >= kth` previously kept every tied entry. That affects `tvd_deploy` only. ### Before your PR is "*Ready for review*" - Is this change backward compatible?: ✅ - If you copied code from any other sources or added a new PIP dependency, did you follow guidance in `CONTRIBUTING.md`: N/A — no copied code, no new dependencies - Did you write any new necessary tests?: ✅ - Did you update [Changelog](https://github.com/NVIDIA/Model-Optimizer/blob/main/CHANGELOG.rst)?: ✅ in [3/8] (one entry for the series) - Did you get Claude approval on this PR?: ❌ pending ### Additional Information **OSS provenance.** No line added by this PR is copied from another project, with or without modification.
