Reviewed the producer and the sparse_data change against the code rather than the description. Approving — the alignment this whole slice turns on is correct, and the failure modes around it are guarded in the right places.
The part that had to be right
policy_record takes logits[first - 1 : end - 1] against gen_ids = ids[first:end], so position t of the stored policy is the distribution ids[t] was drawn from. That is the shift, and the comment is right that dropping it still produces a falling loss curve against the wrong target — which is exactly why it needs the test it has. test_record_round_trips_with_the_shift_the_loss_expects checks it through SparsePolicyDataset per position rather than in aggregate, which is the version that actually catches an off-by-one.
Two defenses around it, both worth keeping:
policy_recordrefusesfirst < 1, andmainseparately clamps with[(max(a, 1), b) for a, b in spans if b > max(a, 1)]and counts the drops innum_invalid. So the raise is a defensive assertion rather than something a real dump can trip, and--answer-only-lossmasking the whole sequence degrades to a skipped record instead of a crashed run.scored_spanssplitting on discontinuities is the right call for multi-turn. Treating everything after the first supervised index as the response would silently score user turns, andtest_multi_turn_spans_do_not_swallow_the_user_turnspins it.
sparse_data.py
Adding top_k to the staleness check is a good catch independent of this PR's feature: a cache built at one width served to a request for another trains against a different objective and makes self.top_k report the cache's value rather than the requested one, so nothing downstream could notice. Narrowing now being refused by the builder rather than silently truncating is the right direction.
Shard publishing
os.replace only on a clean pass, plus refusing to start when the output directory already holds shards for this DP rank, closes the case where a shorter second export leaves the first run's extra shards visible to the trainer's glob. That is a real defect class and easy to miss.
One nit, non-blocking
The -inf convention for nucleus-excluded candidates is well chosen and documented, but it leaves the shards as non-standard JSON: Python writes -Infinity, which RFC 8259 does not allow.
I checked how far that actually bites, and it is milder than it first looks:
- Python's
json.loadsround-trips it exactly, so the in-repo path is unaffected. jqparses it and clamps to-1.7976931348623157e+308, which stillexp()s to0.0— so even a lossy reparse lands on the intended probability.
What does break is a strict parser — Go's encoding/json and Rust's serde_json reject -Infinity outright. Since this is a published artifact format that a non-Python tool might eventually read, a large negative sentinel (or storing probabilities and letting the consumer take the log) would avoid the question entirely. Not worth holding the PR for; worth a line in the README's format description so nobody is surprised.
Not checked
I did not run the tests, and I have not exercised the 27B end-to-end path described in the PR body — I am taking the four-defects-found claim at face value. Nothing in the diff contradicts it.

Reviewed at 2741e84. The rebase is correct: one commit on top of main, independent of [5/8]. Unit tests pass. I ran the script end to end on a tiny Llama with --answer-only-loss and multi-turn conversations, and the output loads.
1. Duplication, removed in this PR as for the earlier slices. Inline suggestions cover the lines in this diff.
deployment_policyreimplements the training-side_deployment_probs. Reuse it; I checked equivalence over 2,000 cases.- The dataset loading/sharding and tokenizer setup are a fourth copy of the blocks in
compute_hidden_states_hf.py/compute_hidden_states_vllm.py. This copy has already diverged: it drops theREMOVE_THINK_CHAT_TEMPLATEstrip that the other dumpers andtransformers_dataset.pyapply. Moving both blocks intocommon.pyasload_conversations/load_tokenizerremoves all the copies.compute_hidden_states_trtllm.pydoes its tokenizer setup differently, so I left it alone. - The cache-match check is now spelled three ways in
sparse_data.py, and the waiting ranks miss the newtop_kcondition (inline comment). One helper fixes both. - Drop
--temperature: it accepts only its default. - Handle position 0 in
scored_spansinstead of both inmain()and with an unreachable raise.
2. Tests: fewer, and they catch more. Drop 3 of the 5 producer tests. The round trip now checks values against the training filter, and the multi-turn test covers the position-0 clamp. Each of these deliberate code changes fails a test: ignoring top-p, dropping the shift, removing the clamp, and a waiting rank ignoring top_k.
What I ran with every suggestion applied (+99/−194 against this PR):
- 592 unit tests pass (sparse, external draft, producer,
main.py, recipe), plustests/examples/speculative_decoding/test_vllm_hidden_states_aux_layers.py. - On the tiny Llama, the producer's dump is byte-identical to the PR's: 10 records over 5 two-turn conversations.
compute_hidden_states_hf.pystill runs end to end after moving to the shared helpers.
Nits (no suggestion)
--shard-sizesays "Conversations per output shard", but the counter counts records: one per assistant turn.--trust-remote-codehere vs--trust_remote_codeincompute_hidden_states_hf.py. Pick one spelling across the dumpers; argparse can accept both through aliases.
Patch for the code outside this diff: sparse_data.py cache-match helper, common.py helpers, and the hf/vllm dumpers moved onto them

Duplication: this reimplements HFExternalDraftModel._deployment_probs. The docstring says the two must track each other. Reusing the function makes drift impossible.
I checked the two over 2,000 random cases (top-k 8/20/100, top-p 0.5–1.0, fp32 and bf16 logits, with ties injected). They agree to 3e-8 everywhere top-k is below the vocabulary size, ties included. So the docstring's claim that they differ on a k-th-place tie does not hold: _deployment_probs also uses topk there.
The only disagreement is top-k ≥ vocabulary with ties, where _deployment_probs switches to its sort-based nucleus. With the suggestion, the dump follows the training filter in that case too.
With this suggestion, the dump this script writes on a tiny Llama is byte-identical to what the PR's version writes. The candidate ids are kept: dropped slots still store -inf.

Handle position 0 in one place. main() already drops it from the spans (L282-284), which makes the first < 1 raise in policy_record unreachable, and its test only checks the message. Clamping in scored_spans lets the multi-turn test cover it (see that test).

Tests: the round trip checked ids and row sums but not the values, so the nucleus needed a test of its own. Comparing the decoded policy with _deployment_probs at the shifted position pins top-k, top-p and the shift in one place. That replaces test_record_reflects_the_nucleus_not_just_the_raw_top_k.
test_span_starting_at_zero_is_rejected goes with the unreachable raise.
I checked this with three deliberate code changes. Each fails a test:
- ignoring top-p: the round trip fails;
- dropping the shift: the round trip fails;
- removing the position-0 clamp: the multi-turn test fails.

There was a problem hiding this comment.
The top_k staleness fix covers only rank 0. _wait_for_cache and the post-build re-check still compare only version and sources.
Under torchrun with an explicit top_k and a cache built at another width:
- rank 0 rebuilds;
- every other rank finds the old
meta.jsonalready matchingsources, so it returns at once and memory-maps the old-width cache.
That is the failure _wait_for_cache's own docstring describes. Repro: build at top_k=8, then construct as rank 1 (process group mocked) with top_k=12. It returns immediately with top_k == 8.
The three comparisons now differ in what they check. One _cache_matches(meta, files, top_k) helper used by all three removes both the duplication and the gap. This line is the inline part; the rest of the patch is in the review body. Explicit top_k is not reachable from main.py today, so this affects the pre-build path and direct users of the dataset.

You are right, and this was my fix being half-done. I added the top_k condition to the staleness computation and never carried it into _wait_for_cache or the post-build re-check, so every non-builder rank would find the old meta.json matching on sources and map the wrong-width cache. That is the exact failure the wait's own docstring describes, which makes it worse.
_cache_matches from your patch now backs all three comparisons, so they cannot drift apart again, and the new test fails if the wait ignores top_k.

Not accurate for top-k. main.py warns when the dump's stored width differs from external.external_top_k under tvd_deploy, using SparsePolicyDataset.top_k. Only top-p goes unrecorded.

Applied in 9c53d1a5. You are right that a top-k mismatch is detected: main.py warns under tvd_deploy from SparsePolicyDataset.top_k. The README now says only top-p goes unrecorded.

Re-reviewed 9c53d1a. All 18 threads are addressed. The code matches my suggested patch. The only additions are the --shard-size help text and the --trust_remote_code alias, and both look good. The 56 sparse/external unit tests pass locally.
One blocker remains, and it comes from my own suggestion. partial-install (torch) fails. The test now imports hf_external at module level, so on an install without transformers it errors at collection instead of skipping (log). That error is also what fails unit-pr-required-check. The inline suggestion below puts the import behind the same importorskip guard that test_external_draft_sparse.py uses. I checked it with transformers blocked: the module skips instead of erroring, and with transformers installed both tests still pass.

Without transformers (the partial-install (torch) job), this import fails collection. Guard it the same way test_external_draft_sparse.py does:
| from modelopt.torch.speculative.external.sparse_data import SparsePolicyDataset | |
| from modelopt.torch.speculative.plugins.hf_external import HFExternalDraftModel | |

Landed in 2b84cdb9, which crossed with your review. Same shape as your suggestion: both importorskip calls first, then the plugin import below them with a comment saying why it sits there.
partial-install (torch) passes at 5m2s on that head, and the PR is 53 passed / 0 failed / 2 skipped.
For what it is worth this was mine to catch, not yours: I fixed the identical ordering in test_external_draft_sparse.py on [4/8] earlier the same day and then did not check the new import against it. I have since audited every test file in this diff for the same pattern.

LGTM once the importorskip("transformers") guard from my last review lands so partial-install (torch) passes.
[4/8] added the consumer for data.sparse_data_path but nothing in the repo produces that format, so the path was unusable. This is the counterpart to compute_hidden_states_hf.py: it stores the base's truncated next-token distribution instead of a hidden state per token, which is what the TVD objectives actually read. Position t of the stored policy is the distribution token t was drawn from, conditioned on everything before it -- the model's logits at t - 1. The round-trip test asserts that alignment against SparsePolicyDataset, since dropping the shift still yields a falling loss curve against the wrong target. Capturing the policy during generation is cheaper and on-policy; left to a follow-up.

Testing
Round-trip test through
SparsePolicyDataset; run end to end against Llama-3.2-1B-Instructand trained on the output.
End-to-end validation. The series was exercised by running the whole workflow on real
models, not unit tests alone: a teacher policy was dumped from a 27B target, three drafts were
trained against it concurrently from one dump -- two sharing the target's tokenizer, one needing
the cross-tokenizer vocabulary swap -- each for a full epoch, and each exported a plain HF
checkpoint whose
architecturesresolves to the draft's own class. Acceptance was then measuredfor all three under a matched target policy. That run surfaced four defects this series' unit
tests and several review passes had all missed, two of which corrupted training silently rather
than failing; all four are fixed here.

A one-line fix to
SparsePolicyDataset's cache staleness check, with a test. The checkcompared only the cache version and the shard list, so an explicitly requested
top_kwassilently dropped when a cache built at another width already existed, and
self.top_kthenreported the cache's width rather than the caller's. Since the stored width truncates or
pads the teacher policy, that quietly changes the objective. An unset
top_kstill acceptswhatever the cache holds, so the inferred-width path is unchanged. It rides here because
this is the PR that decides the stored width.
